| - Add the **external draft** speculative-decoding mode: train a pretrained standalone draft model against a cached base model, instead of grafting a draft head onto the target. Select it with ``mtsp.convert(draft, [("external", cfg)])`` or the ``speculative_external`` recipe; the draft keeps its own embeddings and lm_head and exports as an ordinary HF checkpoint. |

Move the entry to the unreleased 0.48.0 section.
The entry is under 0.47.0 (2026-09-23), and that release has already shipped. The external draft mode is a new feature in this PR. Move the bullet to 0.48.0 (2026-10-xx) → New Features → Speculative Decoding.
As per coding guidelines: "Did you update Changelog ... Very short summary of changes only for new features".

Multi-turn conversations lose the answer-only mask.
Line 205 uses only the first scored position. policy_record then marks every token after that position as gen_ids. In a multi-turn conversation, later user turns and system text fall after the first assistant token. SparsePolicyDataset scores the whole gen_ids span, so the draft trains on user-turn tokens, and --answer-only-loss silently stops working after the first response.
The record schema stores one split point. It cannot represent a mask that has gaps. Use one of these fixes:
- Store the per-position
loss_mask, or the scored spans, in the record. Then have_build_cacheand__getitem__apply that mask. - Reject or warn on a
loss_maskthat is not contiguous:scored[-1] - scored[0] + 1 != scored.numel().

🩺 Stability & Availability | 🟠 Major | 🏗️ Heavy lift
Resuming a dense external run from an HF-format checkpoint does not attach the base lm_head.
The external setup runs only in the else branch, which handles a fresh load. get_last_checkpoint picks up checkpoint-N automatically. Its model.safetensors makes checkpoint_is_hf true, so the run takes the Line 222 branch. That branch loads the draft from the checkpoint, never calls attach_base_lm_head, and skips the vocabulary and tokenizer checks. On the first dense step, _teacher_logits raises Base lm_head is not attached. This affects any interrupted or requeued dense run that writes to the same output_dir. The sparse path is not affected.
Move the base-model load and attach_base_lm_head into a step that runs after both branches whenever the recipe is a ModelOptExternalDraftRecipe in a non-sparse mode. Or reject HF-format resume for this mode with a clear error.

🎯 Functional Correctness | 🟠 Major | ⚡ Quick win
The vocabulary swap is skipped when the two tokenizers differ but have the same size.
The swap runs only when model.config.vocab_size != base_vocab_size. Line 341 then rejects tokenizers that have the same size but different contents. Its error message tells the user to set external_vocab_swap=true, and doc/external_draft.md §5 says the same. A user who follows that advice gets the same error again, because the swap is never run. The workflow has no path forward.
Run the swap whenever external_vocab_swap is set. A swap between identical vocabularies only copies matching rows, so it is safe.

The sparse path never reports training accuracy.
EagleTrainerWithAccLog.compute_loss reads only outputs.train_acc. The dense path sets that attribute at Line 146. The sparse path stores the value in _last_accuracy, and nothing reads that attribute. With external_report_acc=true, which the recipe sets, a sparse run therefore logs no top-1 agreement.

The dense loss mask is not shifted, but the sparse mask is.
In compute_loss, position t compares the two distributions over token t+1. Line 298 weights that position with loss_mask[t], which describes token t. With an answer-only mask, this drops the prediction of the first response token and scores one position past the end of each response. compute_sparse_loss handles the same case correctly with loss_mask[:, 1:seq]. The dense and sparse objectives therefore supervise different positions for the same mask.
Shift the mask so that position t uses loss_mask[t+1]. Pad the last position with zero.

Move the in-function imports to the top of the file.
SPARSE_CAPABLE_LOSSES and DataArguments are imported inside test functions. Neither import has a circular-import or optional-dependency justification. The file already imports from modelopt.torch.speculative at the top. Move both imports to module level, after pytest.importorskip("transformers"), so that import errors surface at collection time.
As per path instructions: "Imports inside functions or test methods without explicit justification. Imports belong at the top of the file so import errors surface at collection time".

Reviewed 6b1c591, the only commit on top of main. I checked every command and flag in the runbook against the code: the producer and dumper flags, discover_shards, data.sparse_cache_dir, the recipe defaults, and the rank-0 cache build. They all exist and match, so the content is accurate. The main issue is duplication.
1. The README section and this doc now say the same things twice. README L136-206 (about 70 lines) already has the sparse-dump command, the training command, the --top-k/--top-p mismatch note, the objectives table, and the tvd_deploy = 1 − acceptance explanation. The doc repeats each of them (objectives table L78-85, mismatch note L73-76, dump command L97-102), and the wording has already drifted ("base" vs "target", which mismatches warn). DFlash already shows the pattern to follow: README L473-514 has a short intro, a quick start and a link, and doc/dflash.md holds the detail. Please do the same here, in this PR. Replace README L136-206 with the block below and keep the detail only in the doc:
## Training a Standalone (External) Draft Model
The modes above graft a draft head onto the target. The `external` mode instead
trains an ordinary pretrained causal LM as the draft: it keeps its own embeddings
and lm_head, the target is never modified, and the result exports as a plain HF
checkpoint that TRT-LLM, vLLM and SGLang load with no mode-specific support.
Dump the target's top-k deployment policy once, then train against it:
```bash
python collect_hidden_states/compute_sparse_policy_hf.py \
--model $BASE_MODEL --input-data $CONVERSATIONS --output-dir $POLICY_DIR \
--top-k 20 --top-p 0.95 --answer-only-loss
torchrun --nproc_per_node 8 main.py \
--config ../../modelopt_recipes/general/speculative_decoding/external_draft.yaml \
model.model_name_or_path=$BASE_MODEL \
draft_model_name_or_path=$DRAFT_MODEL \
data.sparse_data_path=$POLICY_DIR \
training.output_dir=$OUTPUT_DIR
```
See [doc/external_draft.md](doc/external_draft.md) for the recipe parameters, the
dense hidden-state alternative, the objectives, and the cross-tokenizer vocabulary swap.Two things exist only in the README today and need to move into the doc so nothing is lost:
- Online training is rejected, and streaming is accepted but untested for this mode (README L144-149).
- "Report which truncation you trained under, since
top_kandtop_psettings are not interchangeable" (README L205-206).
2. A third copy of the cache pre-build snippet. The same SparsePolicyDataset(discover_shards(...), ...) recipe appears in the external_draft.yaml comment (data.sparse_data_path, with max_length=12288), in the TimeoutError message in sparse_data.py, and now at doc L113-124 (with max_length=4096). The error message has to stay self-contained. With the doc as the reference, though, the yaml comment can shrink to one line pointing at doc/external_draft.md#teacher-policy-data.
3. Two inline fixes to the doc itself: the quick start contradicts the dump section, and the recipe is linked twice.
| torchrun --nproc_per_node 8 main.py \ | ||
| --config ../../modelopt_recipes/general/speculative_decoding/external_draft.yaml \ | ||

The quick start contradicts the dump section below. That section dumps with --max-seq-len 4096, says to set it to training.training_seq_len, and says to point every run at the same data.sparse_cache_dir. This command keeps the recipe defaults instead: training_seq_len: 2048, and a .sparse_cache beside the shards, which the recipe comment notes fails on a read-only dump. Copied as-is, it right-truncates every 4096-token record and builds a second cache.

Done in 80863b5. The quick start now sets training.training_seq_len=4096 and data.sparse_cache_dir=$CACHE_DIR.
One thing I'd rather put back to you than quietly paper over: the reason the two disagreed is that the recipe defaults training_seq_len: 2048 while every worked example in the doc uses 4096 or 12288. Pinning it in the quick start fixes the contradiction but couples the command to one example's value, so a reader who dumps at a different length now reads something confidently wrong instead of silently wrong. Would you rather the recipe default moved? Happy either way, just didn't want to change a recipe default inside a docs PR.
There was a problem hiding this comment.
Agreed: leave the recipe default alone in a docs PR. To avoid tying the commands to one example's value, you could use a single SEQ_LEN=4096 line at the top of the quick start. Then every command reads $SEQ_LEN: the sparse dump (--max-seq-len $SEQ_LEN), the dense dump, the cache pre-build (max_length=$SEQ_LEN) and training (training.training_seq_len=$SEQ_LEN). A reader who changes it then changes all of them together. That's optional and doesn't block approval.
There was a problem hiding this comment.
Good call, done in 2879755. SEQ_LEN=4096 is declared once at the top of the quick start and the four commands in that section read it: training, the sparse dump, the cache pre-build (max_length=$SEQ_LEN, the heredoc is unquoted so it expands) and the dense dump.
The Reference Configuration keeps its literal 12288. That section is a record of one run rather than a template, so I'd rather it stated the value it used.
Worth noting the first pass at this nearly caught the Reference Configuration's torchrun block too, since it is identical to the quick start's down to the line. Only the heading disambiguates them.

Walks the full workflow end to end: dump a teacher policy once, then train several drafts against it, including one whose tokenizer differs from the target's and so needs the vocabulary swap. Documents the objectives and what each one actually scores, the export path (no export step -- the draft is already a plain HF checkpoint), and the failure modes that produce a falling loss curve with no acceptance. Re-reviewed d9708cd. The new Reference Configuration and the three-way Open Items split read well: the recipe values match the recipe and config.py defaults, and effective batch 16 = 1 × 2 × 8 is right. The Open Items buckets look correct to me; the "covered by tests" items all have tests from PRs 1–7.
Still open from my previous review, since this push did not touch them:
- README L136–206 still duplicates this doc. The PR only adds a link inside that section. Please collapse it DFlash-style, per the replacement section I proposed there, and move the two README-only items (online rejected / streaming untested, and "report which truncation you trained under") into this doc.
- Cache pre-build snippet is still in three places; trim the
external_draft.yamlcomment to a pointer todoc/external_draft.md#teacher-policy-data. - Quick start (L45–50) still omits
training.training_seq_len=4096anddata.sparse_cache_dir=$CACHE_DIR(suggestion in the earlier thread), and the recipe is still linked twice (L8 and L55).
New, inline below: two of these are CodeRabbit's findings, which I checked against the dumpers and agree with. The other two remove duplication the new section added.

Agreeing with CodeRabbit here. compute_sparse_policy_hf.py L228 skips on the length of the whole conversation, before it looks at answer spans, and L283–284 print the skipped count. So an under-sized --max-seq-len drops entire conversations, scored tokens included, and it does so loudly rather than silently.

Fixed in 80863b5, and you're right that I had it wrong twice over. The length test at L228 runs on the whole conversation before any answer span is looked at, so it drops the conversation entire, and L283-284 print the count, so it isn't silent either. Reworded to your version.

compute_hidden_states_hf.py defaults --max-seq-len to 3072 and skips any conversation longer than that. The sparse dump above sets 4096 explicitly, so the dense one should match training_seq_len too (CodeRabbit flagged this as well).

Fixed in 80863b5. Confirmed compute_hidden_states_hf.py defaults --max-seq-len to 3072, so following the doc as written gave a sparse dump at 4096 and a dense dump at 3072 over different subsets of the same corpus. The dense command now sets it explicitly.

This repeats the Teacher policy data command (L97–102) and changes only --max-seq-len. I suggest stating the difference instead of repeating the block, so the two cannot drift:

Done in 80863b5. Dropped the repeated first sentence; the general point stays in the swap section at L170.
The teacher policy section handed the reader $CONVERSATIONS without saying where it comes from, which reads as 'use whatever responses you have'. The objective scores the draft at positions it meets when serving, and those lie along the target's own samples, so the responses should be the target's. README already covers producing them under Data Synthesis; link it rather than restate it. Co-Authored-By: Claude Opus 5 <noreply@anthropic.com> Signed-off-by: Peter Hicks <phicks@nvidia.com>
- Quick start pinned training_seq_len=4096 and sparse_cache_dir, which the recipe defaults (2048, cache beside the shards) contradicted. - Dropped the recipe link repeated from the header, and the learning-rate sentence repeated from the swap section. - max-seq-len: the producer skips whole conversations and prints the count, so the previous 'silently drops records' was wrong twice over. - Dense dump now sets --max-seq-len explicitly; it defaults to 3072 and so would have skipped what the sparse dump at 4096 kept. - Second teacher-policy block replaced by a cross-reference, so the two cannot drift. Re-reviewed 80863b5. All six inline threads are addressed. The quick start now sets the sequence length and cache directory. The duplicate recipe link is gone. The --max-seq-len wording and the dense dump's --max-seq-len are fixed. The reference dump now cross-references the earlier command, and the learning-rate note is trimmed. The new note on target-generated conversations is a good addition, and its ../README.md#data-synthesis link resolves.
Two items from my first review are still open, and neither has a reply yet:
- Collapse README L136–206 into a short section that links to this doc. The README still carries the dump command, the training command, the top-k/top-p mismatch note, the objectives table and the acceptance explanation. All of these are now in
doc/external_draft.mdtoo. Please use the replacement section from the first review, DFlash-style. The two README-only items, online training rejected / streaming untested and "report which truncation you trained under", need to move into the doc first. - Trim the cache pre-build snippet in
external_draft.yaml(L31–40) to a pointer todoc/external_draft.md#teacher-policy-data. It is still a third copy of the snippet, and withmax_length=12288it disagrees with the doc's 4096. One line in it exists nowhere else: a ragged third-party dump needstop_k=<its top-k>in the pre-build call. Move that line into the doc's pre-build paragraph rather than dropping it.
The sequence length appeared as a literal 4096 in four places: the quick start, the sparse dump, the cache pre-build and the dense dump. All four have to agree, so a reader changing one silently got a mismatched set. Declare it once and have the commands read it. The Reference Configuration keeps its literal 12288, since that is a record of one particular run rather than a template. Re-reviewed 2879755. The SEQ_LEN change is correct: all four commands read it, and the heredoc is unquoted, so max_length=$SEQ_LEN expands. Keeping the literal 12288 in the Reference Configuration makes sense, since that section records one run.
The two remaining items from my first review have had no reply yet, so I've moved them into inline threads below where they're easier to track. These are the last things before I approve.

Please collapse the external-draft section (README L136–206) into a short pointer to the doc, rather than adding this link inside it. It still carries the dump command, the training command, the top-k/top-p mismatch note, the objectives table and the acceptance explanation, and all of them are now in doc/external_draft.md as well. The two copies will drift: the README dump still hard-codes --max-seq-len, while the doc now uses $SEQ_LEN.
Please follow the DFlash pattern (README L473–514 plus doc/dflash.md): a 2–3 sentence intro, the dump and torchrun commands, and this link. The replacement section in my first review's body is ready to paste. Before deleting, move the two README-only points into the doc:
- online training is rejected and streaming is untested (README L144–149);
- "report which truncation you trained under" (README L205–206).
If you'd rather keep the README section as it is, please reply here with why.

Done in c0ce90f. Replaced README L136-206 with your block, so the section is now the intro, the two commands and the link, matching the DFlash shape.
Both README-only points moved into the doc before deleting:
- streaming accepted but unexercised, and online rejected for want of cached target outputs, into Open Items under "Not yet validated";
- "report which truncation you trained under" into Objectives, next to the top-k/top-p discussion.
Checked nothing else in the tree referenced the deleted lines.

This is now the canonical copy of the cache pre-build snippet. Please trim the copy in the recipe comment (external_draft.yaml L31–40) to a pointer such as # Build the cache once before torchrun: see doc/external_draft.md#teacher-policy-data. That copy is still the third one, and its max_length=12288 disagrees with this doc. Keep the self-contained copy in the TimeoutError message, since that's where a user hits it.
The recipe comment carries one point that's missing here, so move it into this paragraph rather than dropping it. A ragged third-party dump needs top_k=<its top-k> passed to SparsePolicyDataset, because otherwise the cache width is inferred from the first record and the recipe has no field to set it.
There was a problem hiding this comment.
Done in c0ce90f. The recipe comment is now # Build it once before torchrun: see examples/speculative_decoding/doc/external_draft.md#teacher-policy-data, and I verified that anchor resolves against a unique heading. The TimeoutError copy is untouched and still self-contained.
The ragged-dump point moved into the cache pre-build paragraph in the doc, together with the sentence about using discover_shards and the same cache_dir, since the two go together: a cache keyed on a different shard list is ignored and rebuilt, and a ragged third-party dump needs top_k=<its top-k> because the width is otherwise inferred from the first record and the recipe has no field for it.
That also removes the max_length=12288 which disagreed with the doc.
The README section and doc/external_draft.md had grown two copies of the dump command, the training command, the top-k/top-p mismatch note, the objectives table and the acceptance explanation, and the wording had already drifted between them. Follow the DFlash pattern instead: a short intro, the two commands, and a link. Three points lived only in the deleted copies and move into the doc so nothing is lost: - streaming is accepted but unexercised, and online training is rejected, into Open Items; - report which truncation you trained under, into Objectives; - a ragged third-party dump needs top_k passed to SparsePolicyDataset, from the recipe comment into the cache pre-build paragraph. The recipe comment held a third copy of the cache pre-build snippet, with a max_length that disagreed with the doc; it is now a pointer. The copy in the TimeoutError message stays self-contained, since that is where a user meets it. Co-Authored-By: Claude Opus 5 <noreply@anthropic.com> Signed-off-by: Peter Hicks <phicks@nvidia.com>
