[1/4] Calibrate GGML IQ formats with local_hessian, in place of imatrix - #3158
[1/4] of the GGML local-Hessian series. It builds on #3157, which is merged. Merge order: #3158 → #3159 → #3209 → #3218.
Before this PR, local_hessian left GGML weights unchanged, because they have no amax to search. It now encodes each GGML IQ weight once:
One pass, no layerwise calibration: like imatrix, so it fits flows that need a single-pass algorithm, such as AutoQuantize.
Codebook search: keeps imatrix's weighting, the square root of the Hessian diagonal.
Choices: each group's local scale, plus the delta sign for IQ1_S, is picked by the layer-output error dw H dw^T over the 256-column diagonal block of the input Hessian. Before, it was picked by the importance-weighted squared error.
Damping: the Hessian blocks are damped by the new perc_damp (default 0.3), as GPTQ damps. Undamped, the picks overfit the calibration set and did worse end to end.
Pinning: the codes are pinned as imatrix pins them. A weight that already holds codes (GPTQ's) is left alone, so [gptq, local_hessian] works like [gptq, imatrix].
Codes kept until QAD changes a block: under Keep the IQ scales and importance GPTQ chose, so QAD starts from GPTQ's codes #3197 a pinned IQ weight is re-encoded under its pinned scale and importance, which would re-pick the searched local scales. So the encoder also pins a per-block fingerprint of the weight. Blocks still equal to it keep the searched codes (PTQ, eval, export), and a block QAD changed is re-encoded as after GPTQ, with only the super-block scale frozen. GPTQ and imatrix pins carry no fingerprint and behave as before. The fingerprint shares the payload's buffer prefix, so checkpointing, Megatron sharding and export treat it as part of the pin.
The search lives in a new choice_search module:
Encode each block under every choice.
Give each group its best choice under its own H_gg block.
Revisit the groups twice, each taking the choice that most lowers the block's error with the others held.
[3/4] reuses this search inside GPTQ, and [2/4] and [4/4] make it fast.
Other changes:
An encoder registry for local_hessian, mirroring imatrix's.
The imatrix target selection and per-GPU encode loop are factored out of imatrix_calibrate and shared by both algorithms.
Like imatrix, local_hessian now skips the max-calibration forward when no activation quantizer needs one.
Results. Three models with the following weights quantized, same 1,024 calibration samples per arm:
Qwen3.8-27B: the language-model MLP.
GLM-5.3-Flash: all routed experts.
Qwen3.8-Flash-Next: the routed-expert gate_up.
SciCode subtask accuracy (%), 8 runs per arm, INT8 fake-quant serving (BF16 for Flash-Next), 64K cap; local_hessian minus imatrix:
Model
IQ2_XXS
IQ2_XS
IQ2_S
Qwen3.8-27B
9.5 → 16.0 (+6.5 ± 0.8)
20.6 → 26.5 (+5.9 ± 1.0)
32.0 → 34.0 (+2.0 ± 1.1)
GLM-5.3-Flash
3.9 → 9.9 (+6.0 ± 0.5)
12.5 → 18.3 (+5.8 ± 0.5)
31.2 → 30.7 (−0.5 ± 0.6)
Qwen3.8-Flash-Next
38.4 → 37.2 (−1.2 ± 0.9)
40.2 → 39.1 (−1.1 ± 1.1)
41.9 → 42.7 (+0.8 ± 0.8)
Never significantly worse than imatrix. The gains come from fewer runaway (repetition) generations at the two lowest bit widths, which leave fewer subtasks unanswered. Flash-Next never loops.
KL did not predict the outcome: wikitext-2 KL against BF16 was lower on both MoE models at IQ2_XS/IQ2_S, but unchanged on 27B, where SciCode gained most.
Truncation: 10–51% of generations per arm hit the 64K cap, above the 2% validation gate. Read these as relative comparisons under identical settings.
Usage
algorithm:
- {method: gptq}
- {method: local_hessian} # in place of {method: imatrix}; perc_damp defaults to 0.3
The imatrix contract tests are parametrized over both algorithms: pins codes, leaves GPTQ codes alone, refuses a bad width before any state changes, encodes a never-reached weight plainly, runs one forward.
test_local_hessian_lowers_the_output_error_of_correlated_inputs: the local-Hessian pick lowers the output error on correlated inputs.
test_search_under_the_identity_hessian_keeps_the_encoders_own_choices: under H = I, the limit heavy damping tends to, the search reproduces the encoder's own picks.
test_local_hessian_codes_hold_until_qad_changes_a_block: the calibrated weight packs to the searched codes, and a row QAD changed is re-encoded exactly as a GPTQ pin is under Keep the IQ scales and importance GPTQ chose, so QAD starts from GPTQ's codes #3197, its local scales searched again under the pinned super-block scale. It fails without the fingerprint.
I ran the GGML unit and GPU suites on this commit alone on GB300 in the calibration container. I ran the PTQ, KL and SciCode campaign above on oci-jhb.
Not run: multi-rank calibration. local_hessian already warns that it is single-rank for now.
Before your PR is "Ready for review"
Is this change backward compatible?: ✅ (GGML weights were previously untouched by local_hessian. NVFP4 and other amax paths are unchanged, except that the max-calibration forward is skipped when no activation quantizer needs it.)
If you copied code from any other sources or added a new PIP dependency, did you follow guidance in CONTRIBUTING.md: N/A
Added local-Hessian calibration for GGML IQ weights, selecting local scales and IQ1_S deltas based on layer-output error. It can run independently or alongside GPTQ.
Added the perc_damp setting, defaulting to 0.3, to control Hessian damping during IQ-weight scale selection.
Calibration preserves existing codes for unchanged weight blocks and re-encodes blocks that have changed.

Adds blockwise Hessian choice search and registers the GGML encoder. The encoder applies damping when Hessians are available and pins quantized payloads. Pinned codes remain for unchanged weight blocks.
Calibration integration and validation modelopt/torch/quantization/model_calib.py, tests/unit/torch/quantization/test_ggml_imatrix.py, tests/unit/torch/quantization/test_ggml_gptq.py, CHANGELOG.rst
Integrates encoder discovery, Hessian capture, weight encoding, and MSE-search skipping. Imatrix calibration uses shared target and encoding helpers. Tests cover both calibration paths, pinned-code behavior, and GPTQ code preservation. The changelog describes the calibration path.
No actionable issue remains from these findings. The fingerprint is preserved for unchanged weights, and the identified checkpoint-format concern does not block merging.

### What does this PR do?
Type of change: new feature
**[1/5]** of the GGML local-Hessian series. Merge order: #3157 → #3158 →
#3159 → #3209 → #3218.
Each GGML IQ format (IQ2_XXS, IQ2_XS, IQ2_S, IQ1_S, IQ1_M) picks one
choice per group of every 256-value block: a local scale, plus the delta
sign for IQ1_S. It picks the one with the least (importance-weighted)
squared error. `quantize_<format>(..., choices=...)` now takes those
picks as input, in both the CUDA kernels and the PyTorch encoders. The
codebook entries and signs are still searched under the given choice.
This lets a caller pick the scales by another metric. [2/5] uses it to
pick them by the local Hessian.
When `choices` is given, the kernels skip the scoring sweep and keep the
entry search, so the added CUDA code is small (about 13 lines per
encoder family). Each `GGMLFormat` now records `choice_groups` and
`num_choices`.
### Usage
```python
from modelopt.torch.quantization.ggml.registry import GGML_FORMAT_REGISTRY
fmt = GGML_FORMAT_REGISTRY["iq2_xs"]
choices = torch.full((*weight.shape[:-1], weight.shape[-1] // 256, fmt.choice_groups), 7)
packed, shape = fmt.quantize(weight, choices=choices) # every group takes local scale 7
```
### Testing
- `tests/unit/torch/quantization/test_iq_formats.py`: a fixed choice
reproduces, group by group, the payload encoded with that choice
everywhere.
- `tests/gpu/torch/quantization/test_iq_formats_cuda.py`: the CUDA
encoders match the PyTorch encoders byte for byte under random fixed
choices.
- I ran `test_iq_formats.py` and `test_iq_formats_cuda.py` locally on
one GPU (199 passed). I ran the GGML unit and GPU suites (imatrix, GPTQ,
backend, IQ formats) on GB200 in the calibration container.

Nudge: the GGML local-Hessian path looks correct and well tested, but local_hessian now changes weights while its config still allows calib_mutates_weights=False, and an existing-test edit needs human sign-off.
Needs action:
Reject layerwise.calib_mutates_weights=False when local_hessian encodes GGML weights, or explain why not. LocalHessianCalibConfig._mutates_weights is still False, so the validator accepts it. Offloaded layers then skip writeback (persistent_materialization(writeback=calib_mutates_weights)), the pin no longer matches, and the weights are silently re-encoded plainly. The new docstring says "must stay True" but nothing enforces it.
Update the max_calibrate docstring for skip_forward_without_activation_calib. It still lists local Hessian as an algorithm that "call[s] this with the default False", which this PR changes.
Get a human to sign off on the test_ggml_imatrix.py edits. Four imatrix tests are renamed and parametrized over both algorithms. Their assertions are unchanged, apart from the error-message regex now naming the algorithm, so the edit looks justified.
No action needed:
I checked the design: the encoder registry mirrors _IMATRIX_ENCODER_REGISTRY, and _encoder_targets/_encode_weights are shared with imatrix rather than duplicated, so I'm treating the design as settled.
I worked through the math in choice_search._search_block: the diagonal-block extraction, the incremental gradient update and the delta-error formula are correct for a symmetric H, and encode symmetrizes H before the search.
The fixed-choices kernel and encoder changes duplicate #3157, which is already approved.

[1/4] Calibrate GGML IQ formats with local_hessian, in place of imatrix

Thanks. The two code items are addressed in 3beb500:
calib_mutates_weights=False:local_hessian keeps _mutates_weights = False, because its NVFP4 path only updates amax and users rely on that flag for memory. Instead, layerwise_calibrate now refuses the flag before any state changes whenever the model holds a weight a GGML local-Hessian encoder accepts (_refuse_unsaved_local_hessian_encodes in model_calib.py). The LocalHessianCalibConfig docstring now says so. Covered by test_local_hessian_refuses_layerwise_without_weight_writeback, which fails without the check.
max_calibrate docstring: now lists local Hessian among the algorithms that opt into skip_forward_without_activation_calib.
test_ggml_imatrix.py edits: left for human sign-off as requested. The four tests are parametrized over imatrix and local_hessian with unchanged assertions; only the error-message regex now names the algorithm.
Also rebased onto main now that #3157 has merged, so this PR shows only its own two commits. The GGML unit and GPU suites, plus test_layerwise_calibrate.py and test_config_validation.py, pass on this tip (457 passed) and on the top of the stack (463 passed).

Update after #3197 merged, which conflicted with this PR. The PR is rebased on it, and that changes the answer to the first item.
calib_mutates_weights=False: the refusal check from 3beb500 is dropped. Under Keep the IQ scales and importance GPTQ chose, so QAD starts from GPTQ's codes #3197 the encoder no longer writes the weight: it leaves the weight unchanged and keeps its codes in quantizer buffers. Accelerate carries those buffers on and off the GPU independently of writeback, and the layerwise checkpoint saves them as quantizer state. So the flag no longer loses anything, and refusing it would only block a valid setup. The max_calibrate docstring fix is kept.
New: keep the searched codes (3c7e929).Keep the IQ scales and importance GPTQ chose, so QAD starts from GPTQ's codes #3197 re-encodes a pinned IQ weight under its pinned scale and importance, which re-picks each group's local scale and silently discarded local_hessian's choices. The encoder now also pins a per-block fingerprint of the weight. Blocks still equal to it keep the searched codes for PTQ, eval and export; a block QAD changed is re-encoded exactly as a GPTQ pin is, with only the super-block scale frozen. Pins without a fingerprint, GPTQ's and imatrix's, behave as before. The fingerprint uses the payload's buffer prefix, so checkpointing, Megatron sharding and export handle it as part of the pin. Covered by test_local_hessian_codes_hold_until_qad_changes_a_block, which fails without it.
On this tip, the GGML unit and GPU suites plus test_layerwise_calibrate.py, test_config_validation.py, test_fused_experts.py, test_export_weight.py and test_iq1_s_cuda.py pass (686 passed), and 692 pass on the top of the stack.

Unverified finding
Verification ran but could not confirm this finding. It is shown for review, not as a verified issue.
Share the encoder base class and registry with the imatrix encoder.
LocalHessianEncoder repeats ImatrixEncoder almost exactly. Both define accepts and validate with the same docstrings. Both have a dict registry and a register_* function with the same body. Only encode and block_size differ. _encoder_targets in model_calib.py already takes the registry as a parameter, so it needs only accepts and validate.
Move accepts and validate into one small base class. Let each subclass add its own encode. A single registration helper can replace the two near-identical register_* functions. This follows the repository rule to extend an existing mechanism instead of adding a parallel one.
As per coding guidelines: "Prefer the smallest diff, and extending an existing mechanism over adding a parallel one: ask whether something already does this."

LGTM: the earlier calib_mutates_weights concern no longer applies, and the remaining existing-test edits are justified. A human still has to sign off on them.
Needs action:
Get a human to sign off on the test_ggml_imatrix.py edits. Four imatrix tests are now parametrized over imatrix and local_hessian with the same assertions; only the error regex now names the algorithm. One new single-forward test was added.
Fix the LocalHessianCalibConfig and local_hessian_calibrate docstrings, which say the GGML weight is "replaced by its encoding". All five choice formats set payload_scales, so encode returns the weight unchanged. Your own test asserts this (see inline comments).
No action needed:
✔️ Resolved since the last review: the calib_mutates_weights=False writeback risk and the stale max_calibrate docstring.
I checked the _source fingerprint path:
Megatron shards it on the same axis as the payload: dim 0 for column-parallel, dim 1 (blocks) for row-parallel.
HF export drops it through the _ggml_pinned_ skip key.
pin_current_codes keeps it when it re-pins.
The design reuses the imatrix encoder-registry pattern and shares _encoder_targets/_encode_weights, so I'm treating it as settled.

Bot comment.
"The weight is replaced by its encoding" no longer matches the code. All five formats with num_choices > 0 (iq1_s, iq1_m, iq2_xxs, iq2_xs, iq2_s) set payload_scales, so GGMLLocalHessianEncoder.encode returns weight unchanged and only the quantizer buffers change. test_local_hessian_codes_hold_until_qad_changes_a_block asserts torch.equal(model.weight, original). Suggest: "The weight is left unchanged and its codes are pinned to the quantizer, as with imatrix." This matters to users deciding whether calib_mutates_weights=False is safe.

Fixed in ebcea91: the LocalHessianCalibConfig docstring now says the weight is left unchanged and its codes are pinned to the quantizer, as with imatrix.

Bot comment.
Same mismatch here: "replaced by their fake-quantized value" is only true for a format without payload_scales, and every format this encoder currently accepts has them. Suggest saying the codes are pinned to the quantizer and the weight is left as is.
The reason will be displayed to describe this comment to others. Learn more.
Fixed in ebcea91: the local_hessian_calibrate docstring now says the codes are pinned to the quantizer and the weight is left as is. LocalHessianEncoder.encode had the same stale wording and now follows imatrix's "return the weight to keep" contract.
Save/restore of the fingerprint (CodeRabbit):test_pin_survives_save_and_restore now also covers a local_hessian IQ2_XS pin. After mto.save/restore, the restored weight packs to the pinned codes, which requires the source fingerprint to survive the round trip.
Shared encoder base (CodeRabbit):ImatrixEncoder and LocalHessianEncoder now inherit accepts/validate from one small base class. Each keeps its own encode and registry, since each algorithm looks up its own encoder per backend.
Docstring coverage (CodeRabbit): the helpers and closures this PR adds now have docstrings.
The test_ggml_imatrix.py edits still need a human reviewer's sign-off. On this tip, the GGML unit and GPU suites, test_layerwise_calibrate.py, test_config_validation.py, test_fused_experts.py, test_export_weight.py and test_iq1_s_cuda.py pass (687 passed), and 693 pass on the top of the stack.

Nice reuse of the imatrix encoder path. One question, not blocking: local_hessian holds a [in/256, 256, 256] float32 Hessian per weight quantizer until Phase 3a encodes it, where imatrix holds one vector per weight. What was peak CPU/GPU memory on the GLM-5.3-Flash run, and did it use layerwise? If large MoEs need layerwise, a line in the docs would help.
The reason will be displayed to describe this comment to others. Learn more.
Thanks. It didn't use layerwise. The GLM-5.3-Flash runs used the plain recipe ({method: local_hessian}, no layerwise), calibration batch 16, on one node of 4× GB300.
What it holds: each GGML weight keeps in_features / 256 float32 blocks of 256 × 256, i.e. in_features × 1 KiB, which is in_features / 256 of GPTQ's full in² Hessian. GLM-5.3-Flash has 42 MoE layers × 288 experts, each with a fused gate_up (input 4096 → 4 MiB) and a down (input 2048 → 2 MiB):
per expert
whole model
one layer
imatrix vectors
24 KiB
~0.3 GiB
7 MiB
local_hessian blocks
6 MiB
~71 GiB (~18 GiB per GPU)
1.7 GiB
GPTQ full Hessians
80 MiB
~945 GiB
22.5 GiB
Each block is freed as soon as its weight is encoded in Phase 3a. Host memory didn't move: MaxRSS was 698 GiB for local_hessian against 806 GiB for imatrix, both dominated by loading the model. I didn't log peak GPU memory, so the 71 GiB is computed, not measured.
So local_hessian fits this model without layerwise. GPTQ is the one that needs it at this size. A model with a few times more expert parameters per GPU would need layerwise for local_hessian too, where it holds one layer's blocks at a time. I'll add a line to the local_hessian_calibrate docstring saying so.
The reason will be displayed to describe this comment to others. Learn more.
Added in c09abb1: the local_hessian_calibrate docstring now says each encoded weight holds in_features * block_size float32 Hessian entries on its input's device until it is encoded (1 KiB per input feature for GGML), all at once unless layerwise calibration limits it to one layer.
local_hessian previously skipped GGML weights: they have no amax to search.
It now encodes each one once, like imatrix and without layerwise calibration,
keeping imatrix's weighting for the codebook search but picking every group's
local scale (and, for IQ1_S, delta sign) by the layer-output error. The new
choice_search module encodes each 256-column block under every choice, gives
each group its best under its diagonal block of the input Hessian, then
refines group by group. The Hessian blocks are damped by the new perc_damp
(default 0.3); undamped, the picks overfit the calibration inputs. The codes
are pinned as imatrix pins them, so a weight already holding codes, such as

A pinned IQ payload is now re-encoded under its pinned scale and importance
(#3197), which re-picks each group's local scale by the encoder's own search
and so dropped the choices local_hessian picked. The encoder now pins the
weight they were picked for as a per-block fingerprint next to the payload:
blocks still equal to it keep the pinned codes, and a block QAD changed is
re-encoded exactly as after GPTQ, with only the super-block scale frozen. Pins
without a fingerprint, such as GPTQ's and imatrix's, behave as before. The
fingerprint shares the payload's buffer prefix, so checkpointing, Megatron
sharding and export treat it as part of the pin.

Since #3197, local_hessian leaves a GGML IQ weight as it is and pins its codes
to the quantizer, so the LocalHessianCalibConfig, local_hessian_calibrate and
LocalHessianEncoder.encode docstrings now say so instead of "replaced by its
encoding". ImatrixEncoder and LocalHessianEncoder repeated the same accepts and
validate stubs; both now inherit them from one small base class, each keeping
its own encode and registry. The save/restore pin test also covers a
local_hessian pin, whose source fingerprint has to survive the round trip, and
the new helpers and closures get docstrings.

…earch (#3159)
### What does this PR do?
Type of change: new feature (performance)
**[2/4]** of the GGML local-Hessian series. It depends on [1/4] #3158.
Merge order: #3158 → #3159 → #3209 → #3218.
The local-Hessian choice search ([1/4]; GPTQ reuses it in [3/4]) needs
each 256-column block encoded under every choice. [1/4] runs one forced
encode per choice, sweeping the codebook 8–16 times. The IQ encoders now
take `every_choice=True` and return all of those payloads at once,
shaped `[num_choices, *packed shape]`:
- **CUDA kernels:** a new kernel per family keeps each choice's best
codebook entry from a single sweep, using a slot-wise block key minimum.
- **PyTorch encoders:** these loop over forced choices.
The payloads are byte-identical to the forced encodes, so the picks do
not change. `search_choices` decodes them in place into its error
buffer.
**Per 256-column block on a GB300:**
| Rows | Format | Search, [1/4] | Search, this PR |
|---|---|---|---|
| 512 | IQ2_XXS | 13.9 ms | 4.8 ms |
| 512 | IQ2_S | 17.7 ms | 9.1 ms |
| 512 | IQ1_S | 10.6 ms | 4.4 ms |
| 4096 | IQ2_XXS | 17.3 ms | 4.8 ms |
| 4096 | IQ2_S | 22.4 ms | 9.0 ms |
| 4096 | IQ1_S | 31.9 ms | 5.3 ms |
What remains is mostly the scoring and refinement, a few small kernels
per group and sweep, which [4/4] fuses into one launch.
### Usage
```python
packed, shape = fmt.quantize(weight, importance=imp, every_choice=True)
# packed[c] == fmt.quantize(weight, importance=imp, choices=full(c))[0] for every choice c
```
### Testing
- `tests/gpu/torch/quantization/test_iq_formats_cuda.py`: for every
format, the every-choice CUDA payload equals each weighted forced encode
byte for byte.
- Search picks are identical to [1/4] on all five formats on a 1536×1024
weight. The PyTorch every-choice path is exercised by the CPU
`local_hessian` unit tests.
- I ran the GGML unit and GPU suites on this commit alone on GB300 in
the calibration container.

## Summary by CodeRabbit
* **New Features**
* IQ1 and IQ2 quantization can now generate a separate packed result for
every available choice, applying each choice consistently across all
groups.
* The all-choices option is available in both CUDA-accelerated and
standard quantization paths. Existing fixed-choice behavior remains; the
two options cannot be used together.
* **Tests**
* Added coverage comparing all-choice results with results generated
separately for each choice.

What does this PR do?
Type of change: new feature
[1/4] of the GGML local-Hessian series. It builds on #3157, which is merged. Merge order: #3158 → #3159 → #3209 → #3218.
Before this PR,
local_hessianleft GGML weights unchanged, because they have no amax to search. It now encodes each GGML IQ weight once:dw H dw^Tover the 256-column diagonal block of the input Hessian. Before, it was picked by the importance-weighted squared error.perc_damp(default 0.3), as GPTQ damps. Undamped, the picks overfit the calibration set and did worse end to end.[gptq, local_hessian]works like[gptq, imatrix].The search lives in a new
choice_searchmodule:H_ggblock.[3/4] reuses this search inside GPTQ, and [2/4] and [4/4] make it fast.
Other changes:
local_hessian, mirroring imatrix's.imatrix_calibrateand shared by both algorithms.local_hessiannow skips the max-calibration forward when no activation quantizer needs one.Results. Three models with the following weights quantized, same 1,024 calibration samples per arm:
gate_up.SciCode subtask accuracy (%), 8 runs per arm, INT8 fake-quant serving (BF16 for Flash-Next), 64K cap; local_hessian minus imatrix:
