[3/4] Let GPTQ pick GGML IQ local scales by its compensated block Hessian - #3209
[3/4] of the GGML local-Hessian series. [1/4] #3158 and [2/4] #3159 are merged, so this is based on main. Merge order: #3158 → #3159 → #3209 → #3218.
When GPTQ encodes a 256-column GGML block, the format's own search picks each group's local scale by the (importance-weighted) squared error. That isn't the error GPTQ actually pays for the block. Once GPTQ folds the error into the later columns, fixing the block to q costs ‖(w − q) U_gg⁻¹‖², where U is GPTQ's Cholesky factor of the damped inverse Hessian. That is the error gptq_group_update already propagates.
The new GPTQ option local_hessian_scales picks each block's local scales by that error before GPTQ encodes the block and folds its error forward. It uses the same choice search as local_hessian ([1/4]), scored under (U_ggᵀ U_gg)⁻¹.
What changes: only the per-group choices: the local scale, plus the delta sign for IQ1_S.
What doesn't:
The FP16 super-block scale d comes from the format's predictor as before.
The codebook entries and signs are still searched by the encoder with imatrix weighting.
GPTQ's own perc_damp is already in h_inv, so no extra damping is added.
Unreached experts: an expert no calibration token reached keeps the plain search.
Keeping the codes: GPTQ pins the weight it leaves with the per-block fingerprint from [1/4], so PTQ, eval and export keep the searched codes. QAD then behaves exactly as after plain GPTQ: a changed block is re-encoded with only the super-block scale frozen.
Results. IQ2_XXS on the weights listed below, 1,024 calibration samples. GPTQ is layerwise with block 256, perc_damp 0.3 and importance_weighted. Serving is INT8 fake-quant, BF16 for Flash-Next, with a 64K cap. SciCode subtask accuracy (%), 8 runs per arm:

Where it wins: GPTQ + local_hessian_scales is the only arm tied for best on every model. local_hessian alone ties it on 27B and Flash-Next and needs no layerwise calibration; with GPTQ it wins clearly on GLM.
Why, on 27B: it loops least of all arms (50% of generations, against 59% for GPTQ), and fewer generations run to the cap (44% against 57%).
Truncation: 5–44% of generations hit the 64K cap, above the 2% validation gate. Read these as relative comparisons under identical settings.

On a synthetic 1024-input layer with correlated inputs, output error is 28–38% below plain GPTQ on all five IQ formats, held-out inputs included.
Cost. With [2/4]'s one-pass encode, GPTQ with local_hessian_scales takes 2.9× plain GPTQ's time on 16 expert-sized 1536×4096 weights. On GLM-5.3-Flash, calibration took 108 min against 25 min; [4/4] brings that down to 28 min. The option is off by default.
Memory. The search holds every choice's candidate errors for a chunk of rows: num_choices × rows × 256 float32 values, capped at 1 GiB. It also holds two einsum temporaries as large. _update_room now counts this through a new GPTQHelper.update_scratch hook, so update_expert_weights only moves an update to a GPU with room for it. Peak GPU memory of one IQ2_XXS update moved to a second GB200, bf16 weight, importance-weighted:

Without the new term, three of these went over their room, by up to 6.3×. [4/4]'s fused kernel needs no einsum temporaries, so it lowers the estimate to the candidate errors alone.
test_local_hessian_scales_lower_the_output_error_of_correlated_inputs: the option lowers GPTQ's output error by more than 5%. It fails with the search disabled.
test_compensated_block_hessian_is_the_schur_complement_of_the_remaining_columns: checks compensated_block_hessian against inv(inv(H_FF)_gg), computed directly from the damped Hessian. It fails if the plain damped H_gg is returned instead.
tests/gpu/torch/quantization/test_gptq.py::test_an_update_that_may_move_fits_its_room is now also parametrized by local_hessian_scales. Before the room fix, six of the new cases went over their room, for example a 4.0 GB peak against 1.28 GB of room.
I ran the GGML unit and GPU suites, test_autoquant.py and the GPU test_gptq.py on this branch alone on GB200 (oci-jhb), in the calibration container: 46 + 314 + 91 passed. I ran the PTQ, KL and SciCode campaign above on oci-jhb.
Not run: multi-rank GPTQ with this option. The search does no collectives and runs inside each helper's own update.

Added an opt-in local Hessian scales setting for GPTQ quantization. For supported GGML IQ1/IQ2 formats, it selects scales block by block using GPTQ-compensated error and can reduce quantization output error.
The setting is disabled by default. Other formats retain their existing quantization behavior.
Documentation
Updated the 0.49.0 changelog with details about local Hessian scales.
GPTQ now has an optional local_hessian_scales setting. For supported GGML formats with per-group choices and calibration samples, it searches choices using a compensated block Hessian. The update memory estimate includes helper-specific search scratch.

Summary
Local-scale option and GPTQ wiring modelopt/torch/quantization/config.py, modelopt/torch/quantization/model_calib.py, modelopt/torch/quantization/utils/calib_utils.py
GPTQCalibConfig and gptq expose local_hessian_scales, defaulting to False. The calibration path passes the setting to each GPTQ helper, which stores it. The base helper reports zero additional scratch, and update memory estimates include helper-specific scratch.
When local scales are enabled, the format supports choices, and calibration samples exist, the GGML GPTQ helper searches per-group choices using compensated block Hessians. It passes the searched weight when pinning choices and clears its search state. The choice search estimates scratch within its row-chunk bound.
Validation and release note tests/unit/torch/quantization/test_ggml_gptq.py, tests/gpu/torch/quantization/test_gptq.py, CHANGELOG.rst
Tests check the compensated Hessian result, compare output errors with local scales enabled and disabled, and exercise memory-room accounting with both settings. The changelog records the option and reported IQ2_XXS results.

With local_hessian_scales enabled, an expert that calibration never reached can inflate the memory estimate for its whole batch. The batch may then run serially instead of in parallel, which slows calibration. Results stay correct and the option is off by default, so this is a small fix to make before or soon after merge.
Security architecture risk: Low · up to df916
This opt-in change affects numerical output and memory use without an identified expansion of access or authority. Risk is low, with uncertainty around interrupted updates and integrations outside the reviewed code.
Retained concerns
No architecture-level concerns identified.
Security review details
Security Blast Radius
inferred — The supported exposure is the configured calibration run's enabled model weights and expert slices, their retained downstream encodings, and its compute resources. The supplied evidence does not establish a production tenant, service, credential, or environment exposure.
Trust Boundaries and Controls
observed — The option does not select a new backend or grant device authority: backend selection still uses the quantizer's backend. Movable expert work remains restricted to GPUs already held by the process, with cross-device scheduling disabled for multi-rank runs and for GGML fallback encoders.
Resilience and Maintainability Implications
observed — Search runs on a working weight copy before writeback. Successful execution then writes the weight, pins its payload, and clears temporary search state. Writeback and pinning are not one atomic transaction, and pinning writes buffers before computing the source fingerprint. The writeback-then-pin lifecycle predates this PR; interruption recovery for the newly added fingerprinted caller remains unverified.

Explanation
The title "[3/4] Let GPTQ pick GGML IQ local scales by its compensated block Hessian" matches the main change. The PR adds the GPTQ option local_hessian_scales. When enabled, GGML IQ formats choose per-group local scales with the GPTQ-compensated block Hessian. The changeset touches the config, the GPTQ entry point, the GGML helper, the choice search, and the tests, all of which support this behavior. The "[3/4]" prefix marks the position in a series. It does not describe the change, but it does not make the title misleading.

[4/4] Let GPTQ pick GGML IQ local scales by its compensated block Hessian
[4/5] Let GPTQ pick GGML IQ local scales by its compensated block Hessian
Nov 4, 2026
### What does this PR do?
Type of change: new feature
**[1/5]** of the GGML local-Hessian series. Merge order: #3157 → #3158 →
#3159 → #3209 → #3218.
Each GGML IQ format (IQ2_XXS, IQ2_XS, IQ2_S, IQ1_S, IQ1_M) picks one
choice per group of every 256-value block: a local scale, plus the delta
sign for IQ1_S. It picks the one with the least (importance-weighted)
squared error. `quantize_<format>(..., choices=...)` now takes those
picks as input, in both the CUDA kernels and the PyTorch encoders. The
codebook entries and signs are still searched under the given choice.
This lets a caller pick the scales by another metric. [2/5] uses it to
pick them by the local Hessian.
When `choices` is given, the kernels skip the scoring sweep and keep the
entry search, so the added CUDA code is small (about 13 lines per
encoder family). Each `GGMLFormat` now records `choice_groups` and
`num_choices`.
### Usage
```python
from modelopt.torch.quantization.ggml.registry import GGML_FORMAT_REGISTRY
fmt = GGML_FORMAT_REGISTRY["iq2_xs"]
choices = torch.full((*weight.shape[:-1], weight.shape[-1] // 256, fmt.choice_groups), 7)
packed, shape = fmt.quantize(weight, choices=choices) # every group takes local scale 7
```
### Testing
- `tests/unit/torch/quantization/test_iq_formats.py`: a fixed choice
reproduces, group by group, the payload encoded with that choice
everywhere.
- `tests/gpu/torch/quantization/test_iq_formats_cuda.py`: the CUDA
encoders match the PyTorch encoders byte for byte under random fixed
choices.
- I ran `test_iq_formats.py` and `test_iq_formats_cuda.py` locally on
one GPU (199 passed). I ran the GGML unit and GPU suites (imatrix, GPTQ,
backend, IQ formats) on GB200 in the calibration container.

[4/5] Let GPTQ pick GGML IQ local scales by its compensated block Hessian
[3/4] Let GPTQ pick GGML IQ local scales by its compensated block Hessian

…ix (#3158)
### What does this PR do?
Type of change: new feature
**[1/4]** of the GGML local-Hessian series. It builds on #3157, which is
merged. Merge order: #3158 → #3159 → #3209 → #3218.
Before this PR, `local_hessian` left GGML weights unchanged, because
they have no amax to search. It now encodes each GGML IQ weight once:
- **One pass, no layerwise calibration:** like imatrix, so it fits flows
that need a single-pass algorithm, such as AutoQuantize.
- **Codebook search:** keeps imatrix's weighting, the square root of the
Hessian diagonal.
- **Choices:** each group's local scale, plus the delta sign for IQ1_S,
is picked by the layer-output error `dw H dw^T` over the 256-column
diagonal block of the input Hessian. Before, it was picked by the
importance-weighted squared error.
- **Damping:** the Hessian blocks are damped by the new `perc_damp`
(default 0.3), as GPTQ damps. Undamped, the picks overfit the
calibration set and did worse end to end.
- **Pinning:** the codes are pinned as imatrix pins them. A weight that
already holds codes (GPTQ's) is left alone, so `[gptq, local_hessian]`
works like `[gptq, imatrix]`.
- **Codes kept until QAD changes a block:** under #3197 a pinned IQ
weight is re-encoded under its pinned scale and importance, which would
re-pick the searched local scales. So the encoder also pins a per-block
fingerprint of the weight. Blocks still equal to it keep the searched
codes (PTQ, eval, export), and a block QAD changed is re-encoded as
after GPTQ, with only the super-block scale frozen. GPTQ and imatrix
pins carry no fingerprint and behave as before. The fingerprint shares
the payload's buffer prefix, so checkpointing, Megatron sharding and
export treat it as part of the pin.
The search lives in a new `choice_search` module:
1. Encode each block under every choice.
2. Give each group its best choice under its own `H_gg` block.
3. Revisit the groups twice, each taking the choice that most lowers the
block's error with the others held.
[3/4] reuses this search inside GPTQ, and [2/4] and [4/4] make it fast.
Other changes:
- An encoder registry for `local_hessian`, mirroring imatrix's.
- The imatrix target selection and per-GPU encode loop are factored out
of `imatrix_calibrate` and shared by both algorithms.
- Like imatrix, `local_hessian` now skips the max-calibration forward
when no activation quantizer needs one.
**Results.** Three models with the following weights quantized, same
1,024 calibration samples per arm:
- **Qwen3.8-27B:** the language-model MLP.
- **GLM-5.3-Flash:** all routed experts.
- **Qwen3.8-Flash-Next:** the routed-expert `gate_up`.
SciCode subtask accuracy (%), 8 runs per arm, INT8 fake-quant serving
(BF16 for Flash-Next), 64K cap; local_hessian minus imatrix:
| Model | IQ2_XXS | IQ2_XS | IQ2_S |
|---|---|---|---|
| Qwen3.8-27B | 9.5 → 16.0 (**+6.5 ± 0.8**) | 20.6 → 26.5 (**+5.9 ±
1.0**) | 32.0 → 34.0 (+2.0 ± 1.1) |
| GLM-5.3-Flash | 3.9 → 9.9 (**+6.0 ± 0.5**) | 12.5 → 18.3 (**+5.8 ±
0.5**) | 31.2 → 30.7 (−0.5 ± 0.6) |
| Qwen3.8-Flash-Next | 38.4 → 37.2 (−1.2 ± 0.9) | 40.2 → 39.1 (−1.1 ±
1.1) | 41.9 → 42.7 (+0.8 ± 0.8) |
- **Never significantly worse than imatrix.** The gains come from fewer
runaway (repetition) generations at the two lowest bit widths, which
leave fewer subtasks unanswered. Flash-Next never loops.
- **KL did not predict the outcome:** wikitext-2 KL against BF16 was
lower on both MoE models at IQ2_XS/IQ2_S, but unchanged on 27B, where
SciCode gained most.
- **Truncation:** 10–51% of generations per arm hit the 64K cap, above
the 2% validation gate. Read these as relative comparisons under
identical settings.
### Usage
```yaml
algorithm:
- {method: gptq}
- {method: local_hessian} # in place of {method: imatrix}; perc_damp defaults to 0.3
```
### Testing
- `tests/unit/torch/quantization/test_ggml_imatrix.py`:
- The imatrix contract tests are parametrized over both algorithms: pins
codes, leaves GPTQ codes alone, refuses a bad width before any state
changes, encodes a never-reached weight plainly, runs one forward.
- `test_local_hessian_lowers_the_output_error_of_correlated_inputs`: the
local-Hessian pick lowers the output error on correlated inputs.
-
`test_search_under_the_identity_hessian_keeps_the_encoders_own_choices`:
under `H = I`, the limit heavy damping tends to, the search reproduces
the encoder's own picks.
- `test_local_hessian_codes_hold_until_qad_changes_a_block`: the
calibrated weight packs to the searched codes, and a row QAD changed is
re-encoded exactly as a GPTQ pin is under #3197, its local scales
searched again under the pinned super-block scale. It fails without the
fingerprint.
- I ran the GGML unit and GPU suites on this commit alone on GB300 in
the calibration container. I ran the PTQ, KL and SciCode campaign above
on oci-jhb.
- Not run: multi-rank calibration. `local_hessian` already warns that it
is single-rank for now.

…earch (#3159)
### What does this PR do?
Type of change: new feature (performance)
**[2/4]** of the GGML local-Hessian series. It depends on [1/4] #3158.
Merge order: #3158 → #3159 → #3209 → #3218.
The local-Hessian choice search ([1/4]; GPTQ reuses it in [3/4]) needs
each 256-column block encoded under every choice. [1/4] runs one forced
encode per choice, sweeping the codebook 8–16 times. The IQ encoders now
take `every_choice=True` and return all of those payloads at once,
shaped `[num_choices, *packed shape]`:
- **CUDA kernels:** a new kernel per family keeps each choice's best
codebook entry from a single sweep, using a slot-wise block key minimum.
- **PyTorch encoders:** these loop over forced choices.
The payloads are byte-identical to the forced encodes, so the picks do
not change. `search_choices` decodes them in place into its error
buffer.
**Per 256-column block on a GB300:**
| Rows | Format | Search, [1/4] | Search, this PR |
|---|---|---|---|
| 512 | IQ2_XXS | 13.9 ms | 4.8 ms |
| 512 | IQ2_S | 17.7 ms | 9.1 ms |
| 512 | IQ1_S | 10.6 ms | 4.4 ms |
| 4096 | IQ2_XXS | 17.3 ms | 4.8 ms |
| 4096 | IQ2_S | 22.4 ms | 9.0 ms |
| 4096 | IQ1_S | 31.9 ms | 5.3 ms |
What remains is mostly the scoring and refinement, a few small kernels
per group and sweep, which [4/4] fuses into one launch.
### Usage
```python
packed, shape = fmt.quantize(weight, importance=imp, every_choice=True)
# packed[c] == fmt.quantize(weight, importance=imp, choices=full(c))[0] for every choice c
```
### Testing
- `tests/gpu/torch/quantization/test_iq_formats_cuda.py`: for every
format, the every-choice CUDA payload equals each weighted forced encode
byte for byte.
- Search picks are identical to [1/4] on all five formats on a 1536×1024
weight. The PyTorch every-choice path is exercised by the CPU
`local_hessian` unit tests.
- I ran the GGML unit and GPU suites on this commit alone on GB300 in
the calibration container.

picks every group's local scale (and, for IQ1_S, delta sign) by the
importance-weighted squared error. The error GPTQ actually pays for a block,
once the later columns compensate, is ||(w - q) inv(U_gg)||^2 with U the
Cholesky factor of the damped inverse Hessian. With the new
local_hessian_scales option, formats with per-group choices pick them by that
error before GPTQ encodes the block and folds its error forward, with the
choice search local_hessian uses, here under inv(U_gg^T U_gg). The FP16
super-block scale and the codebook search are unchanged.

Nudge: the compensated-Hessian search looks correct and reuses existing code well, but the only test would also pass with the uncompensated Hessian, and nobody has measured the update's peak memory.
Needs action:
Add a unit test in tests/unit/torch/quantization/test_ggml_gptq.py that checks compensated_block_hessian against an independently computed Schur complement (see inline). As written, the end-to-end test would still pass if the plain block Hessian H_gg were scored instead.
Record peak GPU memory for a GPTQ update with local_hessian_scales under Testing, on an expert-sized weight and a wide one. update_expert_weights uses _update_room to decide which GPU an update runs on, and _update_room doesn't count the search's scratch memory (see inline). If the scratch exceeds the estimate, add it there.
No action needed:
Checked: local_hessian_scales reaches GGMLGPTQHelper through wrapped_calib_func → gptq → _make_gptq_handle, which is the only place a helper is constructed.
Checked: inv(U_gg) inv(U_gg)ᵀ is the cost of fixing block g while the later columns compensate. For the last block it reduces to the damped H_gg.
Checked: pinning with source=weight keeps the searched codes through forward, export and pin_current_codes. Only blocks that QAD changes get re-encoded. The new test exercises this through weight_quantizer(weight).
No licensing changes, and the PR is well under the size budget.

The math checks out. Upper Cholesky gives H⁻¹ = UᵀU, so U_ggᵀU_gg is the gg block of inv(H_FF) over the not-yet-quantized columns F, and this returns its inverse. Nothing pins that down, though. test_local_hessian_scales_lower_the_output_error... would still pass if this returned the plain damped H[g, g], because that also beats plain GPTQ. A cheap independent check next to the existing group-update tests (adjust the tolerances if needed):

Added in f5fa120: test_compensated_block_hessian_is_the_schur_complement_of_the_remaining_columns compares it with inv(inv(H_FF)_gg), computed straight from the damped Hessian, for every 4-column group of a 16-column problem. It fails if the function returns the plain damped H_gg.

This adds scratch memory to every group update that _update_room in calib_utils.py doesn't count. Per row chunk, _search_block holds num_choices × rows × 256 float32 candidate errors (capped at 1 GiB by _CANDIDATE_ELEMENTS), plus the every-choice decode and the einsum temporaries. For an [8192, 4096] weight that's roughly 300–400 MiB on top of a ~950 MiB estimate. update_expert_weights uses that estimate to decide which other GPUs can take an update, so it matters once updates_on_any_device() is true. Could you record the measured peak (torch.cuda.max_memory_allocated) with the option on, and extend _update_room if it's over?
The reason will be displayed to describe this comment to others. Learn more.
Measured, and you were right: _update_room undercounted. On a second GB200, a 16384×2048 IQ2_XXS update peaked at 1,123 MiB against 592 MiB of room, and a 65536×256 one at 3,431 MiB against 546 MiB. The search holds the candidate errors plus two einsum temporaries as large. Fixed in df91668: a GPTQHelper.update_scratch hook (0 by default) that _update_room adds, which GGMLGPTQHelper fills from search_scratch() in choice_search.py. test_an_update_that_may_move_fits_its_room is now also parametrized by local_hessian_scales; six of the new cases fail without the fix. Measured peaks are in the PR description under Memory. In #3218 the fused kernel needs no einsum temporaries, so e7c6633 lowers the estimate to the candidate errors alone.

Match the scratch estimate to the search condition.
update_scratch reserves search scratch whenever local_hessian_scales is set and the format has choices. _blockwise_update runs that search only when self.n_samples > 0. For an expert with no calibration samples, the reservation covers a search that never runs.
_update_room takes the maximum room across all movable experts. One such expert can therefore raise the room for the whole batch. When that room exceeds the free memory of all but at most one GPU, update_expert_weights runs the experts serially on their weight devices instead of in parallel.
Add the same condition to update_scratch, so the estimate matches _blockwise_update:

LGTM. Both concerns from the last review are resolved. A human only needs to sign off on one edit to an existing GPU test, and the diff justifies that edit.
Needs action:
Sign off on the edit to test_an_update_that_may_move_fits_its_room in tests/gpu/torch/quantization/test_gptq.py. It adds a local_hessian_scales parametrization. The existing cases and the peak <= _update_room(...) assertion are unchanged.
No action needed:
✔️ Resolved since the last review: the Schur-complement unit test for compensated_block_hessian, and the _update_room undercount. The fix adds an update_scratch hook, and the measured peaks are now in the PR body.
The new test compares the result against inv(inv(H_FF)_gg) built from the damped Hessian. Returning the plain H_gg would fail it for every group except the last.
search_scratch counts the candidate errors, two einsum temporaries and the every-choice payloads. _update_room is only called for movable helpers, and the base hook returns 0.
Design: the PR extends the existing GPTQHelper hook pattern (updates_on_any_device) and reuses search_choices from [1/4], so it adds no second system. It has about 100 logic lines, makes no licensing changes, and the CHANGELOG entry sits under 0.49.0 Quantization.

That isn't the error GPTQ actually pays for the block. Once GPTQ folds the error into the later columns, fixing the block to
