What does this PR do?

Type of change: new feature

Add logged QDQ removal and Constant-to-initializer preprocessing to the private DLA pipeline, plus an independent QDQ rank wrapper. The orchestrator calls each stage in order. QDQ removal defaults to UINT16/INT16 storage and accepts explicit storage selections; Constant folding handles dense, scalar, repeated and sparse numeric values.

QDQ wrapping prepends unit dimensions, adjusts per-axis attributes, and restores the original output rank. It uses versioned Squeeze/Unsqueeze syntax, reserves generated names, and infers missing output types from quantization controls. Blocked quantization stays unchanged until its scales can be promoted safely. For IR versions through 3, a private DLA helper adds the required graph-input descriptors for initializer defaults created by Constant folding, QDQ axes and optional Clip bounds. The newer IR behavior is unchanged. Known ranks with symbolic or unnamed dimensions are padded while retaining their dimension metadata. Runtime-domain per-tensor QDQ keeps an absent axis; explicitly declared axes still shift. Four cases fail against the preceding head and now pass full checking and CPU execution. Custom functions and values captured by nested graphs retain their definitions. Optional input clipping uses the model's Clip schema and output dtype; unsupported clipping is rejected before graph changes.

Part 5/17, based on PR4 #2956. Merge from the bottom of the stack upward. This remains a draft; public integration follows in part 16. This preprocessing slice contains approximately 600 source lines; it retains the agreed 17-part series and includes the fixes required for these operations to stand alone.

Usage

import onnx
from modelopt.onnx.graph_surgery.make_dla_compatible import _transform_make_dla_compatible
from modelopt.onnx.graph_surgery.dla_transforms.dla_handle_qdq import _apply_handle_qdq

model = onnx.load("model.onnx", load_external_data=True)
model = _transform_make_dla_compatible(model, qdq_quantized_dtypes=["uint16", "int16"])
# Independent rank wrapping is available for models with inferred data shapes.
model = _apply_handle_qdq(model)
onnx.checker.check_model(model)

These transformations are not exhaustive; model-specific requirements may need additional passes.

Testing

  • Windows CPU, Python 3.10, ONNX 1.21.0: 67 preprocessing cases and 294 focused graph-surgery tests passed. The final rebased integration suite passed 483 tests, including existing GQA and DQ-transpose regressions.
  • The final regression tests produce 40 failures against the original PR5 production files and all pass with the fixes. Original sources were restored byte-for-byte after the check.
  • Extended existing tests for sparse constants; mixed QDQ nodes and generated-name collisions; legacy native/runtime opsets; untyped outputs; blocked quantization; explicit storage dtypes and omitted zero points; nested-graph captures; and schema-correct clipping with refusal before mutation. A cross-stage CPU execution test verifies that custom functions with recognized operator names keep their semantics. Each introduced case runs well below one second locally.
  • Single-run CPU measurements on synthetic graphs: wrapping 20,000 QDQ nodes improved from 8.250780 to 0.678269 seconds after replacing repeated graph scans with one DLA-local node rebuild. Additional sampled peak RSS was 170.04 MiB. Removing 2,000 pairs took 0.028797 seconds and 7.08 MiB; folding a sparse 4096-by-4096 FP32 constant took 0.075340 seconds and 128.06 MiB while materializing its 64-MiB dense payload. RSS sampling used a 1-ms interval, and every measured result passed full ONNX checking.
  • The legacy-IR requirement is exercised by extending three existing conversion/wrapping/clipping tests. Four cases failed against the preceding implementation; IR4 and modern counterparts verify the boundary without adding helper-only tests. An isolated legacy-IR 20,000-node wrapper measurement took 0.786705 seconds with 185.52 MiB additional sampled peak RSS and passed full checking. The symbolic-shape counterpart took 0.691830 seconds and 170.24 MiB.
  • All introduced source and test functions, including nested helpers, have docstrings. Hooks and signature checks passed. Shared utilities and existing public transformations are unchanged.
python -m pytest tests/unit/onnx/graph_surgery tests/unit/onnx/test_gqa_graph_surgery.py tests/unit/onnx/quantization/test_dq_transpose_surgery.py --noconftest -o addopts= -q --tb=short --durations=8

Tests used offline mode with repository-wide conftest/addopts disabled and real CPU execution. GPU execution and DLA compilation were not run.

📝 Walkthrough

The change adds ONNX transforms for Q/DQ pair removal, Q/DQ rank handling, and Constant-to-initializer conversion. It registers Q/DQ removal and Constant conversion before existing DLA transforms and adds ONNX Runtime parity and domain tests.

Changes: DLA graph transforms

Layer / File(s) Summary
Remove selected Q/DQ pairs
modelopt/onnx/graph_surgery/dla_transforms/dla_remove_qdq.py, tests/unit/onnx/graph_surgery/dla_transforms/test_dla_remove_qdq.py
The transform removes eligible Q/DQ pairs, rewrites node inputs and graph outputs, and handles dtype differences and supported input clipping. Tests cover dtype selection, graph outputs, chains, fanout, scope captures, and unsupported cases.
Pad eligible Q/DQ input ranks
modelopt/onnx/graph_surgery/dla_transforms/dla_handle_qdq.py, tests/unit/onnx/graph_surgery/dla_transforms/test_dla_handle_qdq.py
The transform wraps eligible rank 1–3 Q/DQ data inputs with Unsqueeze and Squeeze nodes and adjusts applicable axes. Tests cover multiple ranks and opsets, blocked quantization, and unchanged 4-D nodes.
Convert constants to initializers
modelopt/onnx/graph_surgery/dla_transforms/dla_constants_to_initializers.py, tests/unit/onnx/graph_surgery/dla_transforms/test_dla_constants_to_initializers.py
The transform converts supported Constant attributes to initializers. Tests cover dense and sparse values, conversion counts, legacy IR handling, and output parity.
Register DLA transforms and verify domains
modelopt/onnx/graph_surgery/make_dla_compatible.py, tests/unit/onnx/graph_surgery/dla_transforms/test_dla_preprocessing_domains.py
The DLA transform list now starts with Q/DQ removal and Constant conversion. Domain tests check that custom local functions with recognized operator names remain unchanged.

Full details: Title check

Explanation

The title "[5/17] DLA QDQ and constant preprocessing" matches the main change. The PR adds DLA preprocessing stages for QDQ removal, a QDQ rank wrapper (handle_qdq), and Constant-to-initializer conversion, and wires them into make_dla_compatible.py. The stack-position prefix "[5/17]" is a series marker rather than a description, but the rest of the title names the primary change accurately and concisely.

Full details: Security Anti-Patterns

Explanation

PASS. The PR changes four production Python files and adds tests only. The authoritative diff contains no torch.load(..., weights_only=False), numpy.load(..., allow_pickle=True), hardcoded trust_remote_code=True, external-input eval()/exec(), or # nosec comments. No pyproject.toml or requirements.txt files changed, so no new PIP dependency was added.

Move the onnxruntime import to module scope.

_prepare_model and _run_ort import onnxruntime inside functions. The module already calls pytest.importorskip("onnxruntime", ...) at line 56. Bind its return value once at module scope. Import errors then appear at collection time, and the in-function imports are no longer needed. The SymbolicShapeInference import can use pytest.importorskip in the same way.

Also, except Exception: pass in _prepare_model hides shape-inference failures. If inference fails, the transform skips the node because the shape is unknown. The failure then surfaces only as a misleading assertion in _assert_wrapped. Log or re-raise the error.

Move test imports to module scope or explain the optional import.

pytest.importorskip("onnxruntime") already checks availability at collection time, but _run_ort imports it during the test. Move that import to module scope. If onnxruntime.tools.symbolic_shape_infer must remain optional, add a brief comment that explains its in-function import. As per path instructions, “Imports belong at the top of the file” except for commented circular-import or optional-dependency reasons.

Addressed the verified preprocessing findings, documented all introduced functions, moved runtime imports to module scope, and replaced swallowed test inference failures with native inference and full checking. Added safeguards for custom functions, lexical captures and optional clipping. 58 preprocessing cases, 285 focused tests, and 474 tests on the rebased integration tip pass; 32 cases fail against the original production code. The DLA-local node rebuild also removes repeated graph scans. Hooks pass; shared utilities and existing public surgeries are unchanged. Requesting a full review of this signed head.

Addressed both new wrapper findings in a38438f: known symbolic ranks are padded without losing dimension metadata, and runtime per-tensor QDQ retains an absent axis. Four cases failed against the previous head and now pass checking and CPU execution. Validation: 62 preprocessing cases, 289 focused tests, and 478 tests on the rebased integration tip pass. All introduced functions have docstrings and hooks pass. Requesting a full review of the new signed head.

Addressed the legacy initializer-input requirement in b9acedc, including the same verified requirement for QDQ axes and Clip bounds. Four before/after cases pass full ONNX checking and CPU execution, and IR4/modern behavior remains covered. Validation: 67 preprocessing cases, 294 focused tests and 483 tests on the rebased integration tip pass. Forty cases fail against the original PR5 source. All introduced functions have docstrings and hooks pass. Requesting a full review of the new signed head.
